Low-Latency RAG Knowledge Agent with Semantic Guardrails
How dense-sparse hybrid vector indexing in Qdrant, Reciprocal Rank Fusion, and Next.js Edge streaming increased retrieval recall to 94.8%, cut hallucinations by 42%, and delivered sub-450ms TTFT streaming.
Semantic Blind Spots, High Latency, and Unchecked Hallucinations
Standard vector retrieval approaches using off-the-shelf naive chunking and basic cosine similarity suffer from significant production failures when applied to enterprise support knowledge bases:
- Keyword Blind Spots: Pure semantic dense vector models fail on exact serial numbers, policy codes, and brand abbreviations, retrieving unrelated text that sounds grammatically similar.
- Cascading Hallucinations: When cosine similarity is weak, feeding low-confidence context to LLMs causes the model to fabricate plausible-sounding answers with no factual backing.
- High Latency: Full synchronous generation before returning output caused multi-second user delays, degrading customer engagement.
Dense-Sparse Hybrid Indexing & Real-Time Streaming
Drawing on empirical benchmarks published by Qdrant and LangChain, I implemented a hardened RAG pipeline combining sparse keyword matching, dense semantic search, similarity rejection gates, and Server-Sent Events:
Context-Aware Chunking
Recursive character chunking preserving document headers, markdown tables, and metadata tags (512 tokens with 10% overlap), ensuring contextual coherence across parent-child document sections.
Dense-Sparse Hybrid Vector Search
Dual-vector indexing in Qdrant pairing 1536-dimensional OpenAI embeddings with BM25 sparse vectors. Merged using Reciprocal Rank Fusion (RRF, k=60), boosting top-5 retrieval recall from 71.4% to 94.8%.
Cosine Similarity Rejection Gate
A strict cosine cutoff threshold of 0.78 rejects out-of-scope context before prompting the model. This bounds factual hallucinations to <2.1% and routes ambiguous questions to human support.
Sub-450ms Edge Streaming & Citations
Tokens stream directly to the Next.js frontend via Server-Sent Events (SSE). Chunks are hyperlinked to interactive source citation badges, allowing users to verify source documentation in real time.
